Generative AI has come a long way in a short time, quickly becoming part of how many of us now live, work and communicate. Tools like Chat GPT and Google Gemini can do everything from drafting emails or writing marketing copy, to generating code and answering complex questions in seconds.
But while most people have used these tools, few understand just what’s happening behind the scenes. While LLMs seem intelligent, what makes them work isn’t intuition or consciousness, but mathematics.
Understanding the mechanics is the key to understanding both the power and the limitations of this new wave of AI. It can also help us understand how businesses can use it effectively and responsibly.
What is an LLM?
At their simplest, Large Language Models (LLMs) are computer programs that are trained to generate human-like text. They sit right at the top of Natural Language Processing (NLP) – the field of AI focused on helping machines understand and use human language.
LLMs can:
- Analyse text (for sentiment, topics, or entities)
- Translate between languages
- Generate content like summaries, reports, or dialogue
- Power chatbots and virtual assistants
But understanding and generating language isn’t easy. Human speech is full of ambiguity, dialects, slang, and subtle context. NLP models need to be able to make sense of these subtleties.
The breakthrough came with Transformer architecture, which is the system that allows AI to understand relationships between words in a sentence, even when they’re far apart.
The result of this breakthrough were models that can read, write, and respond more naturally than anything before them.
How do they actually work?
When you interact with ChatGPT or Gemini, you’re talking to a Generative Pre-trained Transformer:
- Generative – It creates text similar to the examples it learned from.
- Pre-trained – It has already learned language patterns from vast internet datasets.
- Transformer – A model architecture that uses the attention mechanism to identify and focus on the most relevant words in a given context.
Every time you type a prompt, the model converts your text into numbers called embeddings. It then uses its learned weights (billions of parameters) to calculate a probability value for every possible word, then selects the one with the highest value.
The model learns by predicting the next word in sentences where the real next word is known, which means it picks up what’s probable, rather than what’s true. When generating an answer, it just repeats this next-word prediction step until the response is complete.
This probability-based process is why LLMs can sound so natural and yet occasionally get things wrong.
When prediction feels like thought
When an LLM produces a coherent essay, business plan, or line of code, it’s tempting to believe it “knows” something. However, what’s really happening is simply probabilistic pattern completion. The model selects the most likely next token, one after another, based on inputted context and learnt representation.
When this is done billions of times, trained on trillions of examples, you end up with something that sounds remarkably human.
This illusion of understanding is what makes LLMs both powerful and risky. They sound authoritative, because they’re always making the most probable next-token guess. This is a strategy that performs better than admitting uncertainty, even when that guess turns out to be incorrect.
LLMs can be wrong, and still useful
This is the paradox of LLMs. They’re never precisely accurate, but the results can still be considered ‘usefully wrong’.
They generalise patterns, rather than outputting stored facts. Much like a “line of best fit” in statistics. The line may miss individual points but still captures the trend. Likewise, an LLM’s answer may not be perfectly true, but it’s often directionally helpful. And when combined with internet search or retrieval tools, it can ground those generalisations in real, current information.
For businesses, this distinction is crucial. LLMs aren’t databases or knowledge engines. They’re accelerators, and tools for generating language-based output at scale.
Why businesses should care
Every business runs on language. We use emails, reports, analysis, customer interactions, and code daily. LLMs make working with language faster and more scalable than ever.
But to use them wisely, you need to understand both their advantages and their limitations.

- Scalable expertise: LLMs can draft content, summarise reports, and generate insights far faster than human teams.
- Speed and efficiency: Tasks that took hours can now take minutes.
- Adaptability: One model can serve HR, marketing, operations, and analytics without retraining.
- Natural interaction: Instead of coding or querying, anyone can simply ask.
- Non-deterministic creativity: Because they don’t always answer the same way, LLMs can produce varied ideas, a strength for brainstorming or design.
The limitations
- Hallucinations: When the model lacks knowledge, it guesses, and often does this persuasively.
- Bias: Models can reflect the biases present in their training data.
- Inconsistency: You’re likely to get different answers when asking the same question repeatedly.
- Overtrust: Humans tend to believe outputs to be true.
This is why human oversight is not optional, it’s essential.
A framework for collaboration
The most successful organisations treat LLMs as assistants, not replacements. Making the most of this collaboration involves understanding where strengths lie, and where they can be put to best use.

How to use LLMs safely and strategically
Start small, stay intentional, and always keep a human in the loop when making decisions.
Start with low-risk, high-volume tasks
Start with tasks like summaries, meeting notes, and idea generation. These are tasks where errors are easily spotted and corrected.
Pair outputs with validation
Use automated checks or simple human review to catch hallucinations before they reach production.
Build understanding, not blind trust
Train teams on how LLMs work. Humans need to understand why LLMs fail, where they shine, and how to design prompts that add context.
Use the right tool for the job
For creativity and reasoning, use an LLM. For factual precision, pair it with structured data or a retrieval system (like RAG).
Keep humans as the decision points
Although we should use the model to assist us, humans must remain accountable for what gets published, approved, or deployed.
The bottom line
LLMs are powerful tools for scaling knowledge work, not replacements for it. They excel at pattern recognition, summarisation, and synthesis, but not in truth or judgment.
For CTOs and business leaders, the opportunity lies in building processes that use these systems deliberately; to embed guardrails, automate low-risk workflows, and give teams confidence to experiment safely.
